Overview of RDMA in Distributed Machine Learning

Remote Direct Memory Access (RDMA) has long been recognized for its potential to reduce communication overhead in distributed systems. However, deploying RDMA in production environments for large-scale inference and training workloads requires more than simply replacing traditional protocols like TCP. The paper "Deploying RDMA for Large-Scale Inference and Training Workloads" details the deployment of ByteExpress, a software communication layer built on top of hardware RDMA, within ByteDance's parameter-server-based systems. This implementation addresses several challenges that arise in real-world scenarios, including variable message sizes, concurrent connections, and service failures.

Key Design Considerations

The deployment of ByteExpress highlights three critical lessons learned from the implementation. First, efficient RDMA requires coordinated buffer management across both the application and transport layers. This ensures that memory allocation and data transfer are optimized without unnecessary overhead. Second, scalable communication necessitates the coordinated management of connections, receive capacity, and outstanding data. This is particularly important in environments with high concurrency and variable traffic patterns. Third, service availability in production systems requires recovery mechanisms that operate above the transport layer, ensuring resilience in the face of failures.

ByteExpress incorporates several features to address these challenges. These include an RDMA-aware memory allocator, zero-copy data transfers, Quality of Service (QP) multiplexing, receive-credit flow control, a software send window, and RPC-assisted recovery. These components work together to optimize performance and reliability in large-scale distributed systems.

Performance Improvements in Production

The deployment of ByteExpress in ByteDance's inference and training systems has yielded measurable performance improvements. In production inference, ByteExpress reduces the mean and P99 model parameter fetch latency by 35.7% and 43.7%, respectively, compared to kernel TCP. Additionally, total CPU usage is reduced by 10.69%. In training scenarios, ByteExpress reduces P99 model parameter push latency by up to 74.0% compared to TCP, with no PFC pauses observed during runtime. These results demonstrate the effectiveness of the ByteExpress implementation in optimizing communication performance in real-world environments.

While the paper provides detailed insights into the deployment of RDMA in large-scale systems, it also highlights the importance of software-layer optimizations that complement hardware capabilities. These optimizations are essential for achieving the full potential of RDMA in production environments.
